Project 5: Facial Keypoint Detection with Neural Networks

Overview

In this project, you will learn how to use neural networks to automatically detect facial keypoints.

Part 1: Nose Tip Detection

Dataloader

I wrote a customized Dataset: class IMMFaceDataset(Dataset) that holds dictionaries of samples of the form {'image': image, 'landmarks': landmarks} and auxiliary transforms to normalize and rescale. Then I used the dataloader from torch.utils.data.DataLoader. Below are some images sampled from my dataloader visualized with ground-truth keypoints.

CNN

I designed a network with three convolutional layers and two fully connected layers:

I used a learning rate of 0.001 and trained it for 20 epochs and the MSE loss over time is shown below:

Results

pred_2 shows 2 correct predictions and 2 incorrect predictions. The incorrect predictions are probably due to overfitting to training data, which in turn causes the model to not generalize well to the validation set.

Part 2: Full Facial Keypoints Detection

Dataloader

I used the same customized Dataset: class IMMFaceDataset(Dataset) that holds dictionaries of samples of the form {'image': image, 'landmarks': landmarks} and auxiliary transforms to normalize and rescale. This time, to prevent overfitting due to the limited size of my data, I implemented data augmentation via applying transforms on the fly. These new transforms include RandomShift, RandomColorJitter, and RandomRotation. Then I used the dataloader from torch.utils.data.DataLoader. Below are some images sampled from my dataloader visualized with ground-truth keypoints.

I designed a network with 5 convolutional layers and 3 fully connected layers:

I used a learning rate of 0.001 and trained it for 100 epochs and the MSE loss over time is shown below:

Results

pred_1 shows 2 correct predictions and 2 incorrect predictions. The incorrect predictions, in this particular case, seem to be caused by the shadows on the chin, shifting the jawline predictions and thereby everything above the ground truth points.

I have also visualized the filters learned for my first convolutional layer (7 x 7 kernels):

Part 3: Train With Larger Dataset

Dataloader

In the ibug dataset, the face may occupy only a very small fraction of the entire image (most are the background), which means we need to crop the image and feed only the face portion. I cropped the image using the bounding boxes, resized the crop into 224x224, and updated the keypoints accordingly. I then applied the same data augmentation techniques from part 2.

CNN

I used resnext50 pretrained on ImageNet. Two modifications on the model are required: For the first layer, I changed the input channel to 1 for as the inputs are grayscale images. For the last layer, the output channel number should be 68 * 2 = 136, i.e., the (x, y) coordinates of the 68 landmarks for each face.

Results

Above are some images visualized with the keypoints prediction in the testing set. I then converted the keypoint predictions back to absolute pixel coordinates in the original image:

I ran the model on my images as well:

It worked pretty well on human faces yet failed miserably on my cat's face, which is reasonable.
